Large language models (LLMs) like ChatGPT and GPT4 have gained significant attention in the field of natural language processing and artificial intelligence due to their impressive ability to generate human-like text. However, one limitation of LLMs is their lack of access to factual knowledge, as they are essentially black-box models. On the other hand, Knowledge Graphs (KGs), such as Wikipedia and Huapu, provide structured representations of rich factual knowledge. KGs can enhance LLMs by offering external knowledge for inference and interpretability. The construction and evolution of KGs present challenges in generating new facts and representing unseen knowledge. Therefore, it is beneficial to integrate LLMs and KGs together to leverage their respective advantages. This article presents a forward-looking roadmap for the unification of LLMs and KGs. The proposed roadmap consists of three general frameworks: 1) KG-enhanced LLMs; 2) LLM-augmented KGs; 3) Synergized LLMs + KGs. The first framework involves incorporating KGs during the pre-training and inference phases of LLMs in order to enhance the understanding of knowledge learned by them through integration with external structured knowledge. The second framework utilizes LLMs for various KG tasks such as embedding, completion, construction, graph-to-text generation, and question answering in order to improve performance on those tasks by leveraging the capabilities of LLMs. Lastly, the third framework emphasizes equal participation from both sides in a mutually beneficial manner to enhance bidirectional reasoning driven by both data and knowledge which aims at improving both model performance as well as representation of knowledge in KGs. The article reviews existing efforts within these three frameworks and identifies future research directions including improving pre-training methods for incorporating external knowledge into LLM models; developing effective strategies for utilizing LLMs in KG related tasks; investigating novel techniques for synergizing LLMs and KGs etc.. In summary, the integration of LLMs and KGs holds great potential for advancing natural language processing and artificial intelligence by combining emergent ability & generalizability of former with rich factual information stored in latter thus enhancing performance & understanding complex language tasks better than ever before.

Large language models (LLMs) like ChatGPT and GPT4 are advanced AI systems that can generate text that sounds like it was written by a human. However, they don't know facts about the world because they are like black boxes. Knowledge Graphs (KGs) are structured representations of factual information. KGs can help LLMs by providing them with external knowledge to understand and explain things better. Combining LLMs and KGs can make both of them even more powerful. Future research will focus on improving how LLMs learn from external knowledge and finding new ways to use LLMs and KGs together. This integration has the potential to improve how computers understand and process human language by combining the strengths of both systems.

Unifying Large Language Models and Knowledge Graphs: A Roadmap
Large language models (LLMs) such as ChatGPT and GPT4 have gained significant attention in the field of natural language processing and artificial intelligence due to their impressive ability to generate human-like text. However, one limitation of LLMs is their lack of access to factual knowledge, as they are essentially black-box models. KGs can enhance LLMs by offering external knowledge for inference and interpretability. The construction and evolution of KGs present challenges in generating new facts and representing unseen knowledge. Therefore, it is beneficial to integrate LLMs and KGs together to leverage their respective advantages. This article presents a forward-looking roadmap for the unification of LLMs and KGs which reviews existing efforts within three general frameworks: 1) KG-enhanced LLMs; 2) LLM-augmented KGs; 3) Synergized LLMs + KGs
KG Enhanced Large Language Models
The first framework involves incorporating KGs during the pre-training and inference phases of LLMs in order to enhance understanding of knowledge learned by them through integration with external structured knowledge. For example, recent work has demonstrated that integrating external commonsense or domain specific information into pre-trained language models can improve performance on downstream tasks such as question answering or sentiment analysis. Furthermore, some studies have explored methods for improving interpretability by utilizing external structured information from a KB during model inference phase which allows us to better understand how an output was generated given certain input conditions or parameters.
LLM Augmented Knowledge Graphs
The second framework utilizes LLMs for various KG tasks such as embedding, completion, construction, graph-to-text generation, question answering etc., in order to improve performance on those tasks by leveraging capabilities of both sides simultaneously i.e., using large scale training data available from pre trained language models along with rich semantic information stored in KBs . For instance , recent research has shown that combining transformer based architectures with graph neural networks can lead to improved results on link prediction task compared with traditional methods like matrix factorization . Similarly , some studies have also explored ways for generating textual descriptions from graphs using transformer based architectures instead of relying solely on rule based approaches .
Synergized Large Language Models & Knowledge Graphs
Lastly , the third framework emphasizes equal participation from both sides in a mutually beneficial manner so as to enhance bidirectional reasoning driven by both data & knowledge which aims at improving both model performance & representation of knowledge in KBs . One approach towards achieving this goal is through joint learning techniques where we combine supervised learning objectives over multiple datasets related either directly or indirectly with each other e .g., jointly training an entity recognition system over text corpus & corresponding entities extracted from a KB could potentially lead us towards better understanding complex relations between different entities mentioned across documents . Another promising direction involves exploring ways for transferring useful features learnt while training one model onto another e .g., transfer learning techniques used recently for fine tuning BERT model over different NLP tasks could be extended further so as incorporate additional features learnt while training a separate entity recognition system over corresponding KB dataset thus leading us towards more efficient utilization resources available across two sides i .e., large scale unlabeled text corpus & rich semantic information stored inside KBs respectively .
Conclusion
In summary , the integration of large language models & knowledge graphs holds great potential for advancing natural language processing & artificial intelligence by combining emergent ability & generalizability offered by former alongside rich factual information stored inside latter thus enhancing performance & understanding complex language tasks better than ever before . Future research directions include improving pre - training methods for incorporating external knowledge into LMM models ; developing effective strategies for utilizing LMMS in kg related tasks ; investigating novel techniques synergizing LMMS&KGS etc..
