Reinforcement learning has emerged as a promising approach for solving combinatorial optimization problems such as the Traveling Salesman Problem (TSP). Attention-based encoder-decoder models have shown high effectiveness in solving routing problems. However, these models fail to perform well when applied to the TSP with Drone (TSP-D), which involves coordinating a heterogeneous fleet of vehicles consisting of a truck and a drone. In TSP-D, the vehicles move together and may need to wait at certain nodes for the other vehicle to join. The state-less attention-based decoder lacks the ability to coordinate between vehicles in this scenario. To address this limitation, the authors propose a hybrid model that combines an attention encoder with a Long Short-Term Memory (LSTM) network decoder. The LSTM decoder's hidden state is able to represent the sequence of actions made, enabling better coordination between the truck and drone. Experimental results demonstrate that this hybrid model improves both solution quality and computational efficiency compared to a purely attention-based model. The authors also conduct experiments on the min-max Capacitated Vehicle Routing Problem (mmCVRP) and find that the hybrid model is more suitable for coordinated routing of multiple vehicles than the attention-based model. Furthermore, the proposed model achieves comparable results to operations research baseline methods. Overall, this study presents a deep reinforcement learning approach for solving TSP-D using a hybrid model that combines an attention encoder with an LSTM network decoder. The empirical results highlight the effectiveness of this approach in improving solution quality and computational efficiency in comparison to existing models.

Reinforcement learning has become a popular approach for solving combinatorial optimization problems, such as the Traveling Salesman Problem (TSP). This problem involves finding the shortest route that visits each city exactly once and returns to the starting point. It is a well-known NP-hard problem with numerous real-world applications, including transportation planning, logistics, and supply chain management.
Recent advancements in deep learning have led to the development of attention-based encoder-decoder models that have shown high effectiveness in solving routing problems. These models use an attention mechanism to focus on relevant parts of the input sequence while generating an output sequence. However, they fail to perform well when applied to more complex versions of TSP, such as TSP with Drone (TSP-D).
In TSP-D, instead of a single vehicle traveling between cities, there are two vehicles: a truck and a drone. The truck carries most of the load while the drone assists by delivering parcels or packages at certain nodes along the route. The challenge here is coordinating between these two vehicles as they move together and may need to wait at certain nodes for one another.
To address this limitation, researchers from Carnegie Mellon University propose a hybrid model that combines an attention encoder with a Long Short-Term Memory (LSTM) network decoder for solving TSP-D. LSTM networks are commonly used in sequential data tasks due to their ability to remember information over long periods.
The proposed hybrid model consists of three components: an attention encoder network, an LSTM decoder network, and a coordination module. The attention encoder takes in information about the cities' locations and generates embeddings representing each city's features. These embeddings are then fed into the LSTM decoder along with previous actions taken by both vehicles.
The key contribution of this study is incorporating a coordination module into the LSTM decoder's hidden state representation. This allows for better coordination between the truck and drone during route planning. By considering past actions taken by both vehicles, the model can make more informed decisions about when to wait for the other vehicle and when to continue moving.
The researchers conducted experiments on various TSP-D instances and compared their proposed hybrid model with a purely attention-based model. The results showed that the hybrid model outperforms the attention-based model in terms of solution quality and computational efficiency. This is because the LSTM decoder's hidden state can capture long-term dependencies between actions, leading to better coordination between vehicles.
Moreover, the researchers also tested their hybrid model on another routing problem called min-max Capacitated Vehicle Routing Problem (mmCVRP). This problem involves finding routes for multiple vehicles with different capacities while minimizing the maximum distance traveled by any vehicle. The results showed that the hybrid model is more suitable for coordinated routing of multiple vehicles than the attention-based model.
To further validate their approach, the authors compared their results with existing operations research baseline methods commonly used for solving TSP-D. The experimental results showed that their proposed hybrid model achieves comparable or even better solutions than these baseline methods.
In conclusion, this study presents a deep reinforcement learning approach for solving TSP-D using a hybrid model that combines an attention encoder with an LSTM network decoder. By incorporating a coordination module into the hidden state representation of the LSTM decoder, this approach improves solution quality and computational efficiency compared to existing models. The empirical results highlight its effectiveness in solving complex routing problems involving multiple vehicles and demonstrate its potential for real-world applications in transportation planning and logistics management.
